Finding building energy performance problems is a critical step in improving energy efficiency in buildings and in reaching a building's performance goals established during design. The prevalent method of improving building energy performance is to look for relative improvements on the basis of measured performance data, sometimes with a "calibrated" energy simulation model that is made to mimic the actual consumption as closely as possible. This approach is problematic because compensation errors often mask the performance problems one wants to find, a true baseline model is not established, and there is little certainty that the identified improvements capture all major performance problems. Typically, these assessment methods focus on either the building/system level or the component level, but do not consider all levels of detail. Furthermore, existing methods do not combine spatial and thermal perspectives and do not consider the relationships between components of a building's energy system, the HVAC (heating, ventilation, and air conditioning) systems, HVAC components, zones, spaces, and the building. However, improving this interaction, i.e., using the energy system for maximum effect in a building's spaces, is precisely what building operators and users are after. The effect of these shortcomings is that identification of energy performance problems tends to be haphazard and requires great effort. To address these gaps in knowledge and corresponding shortcomings, I formalized the Energy Performance Comparison Methodology (ECPM) to identify performance problems from a comparison of measured and simulated energy performance data. It extends prior hierarchies to describe a building and its energy system more fully so that the comparison and analysis includes the spatial and thermal perspectives and all levels of detail in a building, including the relevant relationships. It formalizes measurement assumptions and simulations assumptions, approximations, and simplifications (AAS) so that measured and simulated data can be assessed while considering all known limitations. This thesis describes this EPCM and its related contributions to knowledge. It also shows that a professional, called performance assessor, can identify more problems with less effort per problem than with existing methods. The assessor uses whole building energy performance simulation (BEPS) tools, such as EnergyPlus, to generate simulated data sets for the EPCM. Measured data come from physical measurements by sensors strategically placed in buildings and control data points such as set points. By enabling a meaningful comparison of measured and simulated data, this thesis enables future research to establish expert systems that can automatically detect performance problems and correct them, allow the virtual testing of energy efficiency improvements and innovations, and provide feedback to building designers and operators for ongoing improvement of the design and building operations methods.

Many technical solutions have been developed to reduce buildings' energy consumption, but limited efforts have been made to adequately address the role or action of building occupants in this process. On the other side, Building Management System (BMS) monitors the performance of buildings by recording the data to improve the building operation, control systems and maintenance. Usually, BMS produces a large volume of data throughout the year including information with regard to patterns of energy use, occupant behavior, etc. The availability of this huge data has created an opportunity to extract information to improve the building energy performance through leveraging powerful data analytic tools. The objectives defined in this thesis lie in developing methodologies to find energy saving opportunities by analyzing data coming from occupants' energy consumption. Three tasks are defined in this thesis. The first task is to provide a recommender system to alert the occupants to take certain measures in order to reduce their energy consumption through end-use loads. Therefore, the quantification of potential savings is provided upon following recommendations. The proposed methodology is also capable to detect the energy saving measures performed by occupants. The second task focuses on a systematic comparison procedure between the buildings to make the occupants aware of their rank among other buildings and hence give them clues on how to improve their performance. The third task focuses on developing a framework to create a reference building acting as a reference for a given building. Therefore, the given building can be compared against its reference building. Potential savings are given to the given building along with directions how to achieve them. The results show successfulness of developed methodologies in finding energy saving opportunities through modifying occupant behavior.

BAS data are usually stored in a single two-dimensional data table, where each column represents a variable and each row is an observation consisting of the values of different variables. Cross-sectional knowledge refers to the relationships and associations between variables (i.e., different columns) without taking into account the temporal dependency. A number of DM techniques, including clustering analysis, association rule mining and decision trees, are adopted to discover cross-sectional knowledge and to improve the reliability of the knowledge discovered. Post-mining methods, which bridge the knowledge discovered by DM techniques and domain expertise, are developed to enhance the efficiency and effectiveness in knowledge selection and application. Valuable knowledge has been discovered to understand building operation behaviors and spot energy conservation opportunities. Different from cross-sectional knowledge, temporal knowledge discovery focuses on discovering the temporal relationships between observations (i.e., different rows). In this case, the observations are considered as multivariate time series. The symbolic aggregation approximation (SAX), motif discovery and temporal association rule mining are applied as the main DM techniques. Two post-mining methods are developed to effectively utilize the knowledge discovered. The knowledge discovered can be used to characterize the dynamics in building operations and facilitate fault diagnosis and control optimization. A graph-based DM technique is developed for mining BAS data with potentially complex structures, rather than just a single two-dimensional data table. It ensures the knowledge discovery efficiency when the BAS data structure is complex, e.g., data are stored in multi-relational databases and cannot be easily merged into a single data table. With the population of building information modelling, a huge amount of valuable information related to building design and operations is becoming available for analysis, such as the text data for building construction and maintenance, and the spatial information of system components. Graphs provide great flexibility in integrating and representing various types of information; and the knowledge discovered using graph-based DM is highly interpretable. The frequent subgraph mining (FSM) and graph-based anomaly detection (GBAD) are selected as the primary mining techniques. Two problems are specifically addressed, i.e., graph generation based on BAS data and efficiency enhancement in knowledge selection and application. The graph-based mining methodology has been applied to represent different types of information, based on which frequent and atypical building operation patterns are detected. BAS data retrieved from the tallest building in Hong Kong and the Zero-Carbon Building are used to test and evaluate the methodologies. The results show that the knowledge discovered is valuable to identify dynamics, patterns and anomalies in building operations, assess building system performance and spot opportunities in energy conservation. The framework and the methodologies can contribute to develop more powerful and sophisticated BAS tools for effective utilizing the big BAS data for building energy management.
