In recent years, predictive maintenance (PdM) has gained significant attention in both industry and academia due to the utilization of real-time data from Industry 4.0, enabling equipment health monitoring and remaining useful life (RUL) estimation. However, studies often focus on failure prediction while neglecting decision-making and maintenance planning. Additionally, not all equipment can be maintained solely through PdM, necessitating the integration of preventive maintenance (PvM). This thesis proposes novel approaches for PdM and PvM using data science and mathematical optimization. It addresses key questions, including estimating equipment health and RUL, and incorporating data into decision-making and maintenance planning. A comprehensive Predictive Maintenance Management System (PdMMS) approach is introduced, covering criticality analysis, appropriate maintenance strategies, data acquisition, monitoring systems, health monitoring, RUL estimation, and overall maintenance planning. Several methods and algorithms are developed and applied at the FPT Powertrain Technologies Bourbon-Lancy (FPT-BLY) plant. An innovative approach for identifying maintenance strategies is presented, utilizing multi-criteria decision-making, ABC analysis, sensitivity analysis, and optimal frequency identification. This approach successfully identifies critical equipment, reducing emergency purchases. Relevant maintenance indicators and visualization dashboards are proposed for monitoring and improvement. For equipment health monitoring and RUL estimation, a health indicator (HI) method and a dynamic algorithm are developed and applied to a conveyer chain painting system. Results demonstrate dynamic estimation based on real-time data. Simultaneous PdM and PvM planning is addressed through a mathematical optimization model, considering direct (intervention costs) and indirect costs (expected failure risk costs, unused life losses) while accounting for opportunistic grouping of maintenance interventions. Integrating RUL information into maintenance planning yields optimal results, as validated by a sensitivity analysis indicating reduced long-term costs. The thesis discusses challenges of implementing the proposed PdMMS approach in other companies, provides managerial insights, and outlines future research directions.
